Résumé

The rising complexity and frequency of cyber-attacks, including Distributed Denial of Service (DDoS), malware, and phishing, pose significant challenges for organizations in safeguarding their networks. Traditional cybersecurity systems, which often rely on static rules and manual interventions, struggle to detect and respond to threats in real time. This project addresses these challenges by developing an AI-driven cybersecurity solution that leverages advanced machine learning techniques, including Deep Q-Networks (DQN), Autoencoders, Proximal Policy Optimization (PPO), and Genetic Algorithms (GA). The system aims to provide real-time threat detection, automated response mechanisms, and network traffic optimization, offering a more dynamic and adaptive defense strategy against modern cyber threats. The project utilizes the CICIDS 2017 dataset, which includes diverse types of both normal and malicious network traffic. A comprehensive preprocessing phase is employed to clean and normalize the data, addressing missing values and ensuring consistency. Principal Component Analysis (PCA) is applied to reduce the dimensionality of the dataset, enhancing the efficiency of model training. Autoencoders are then used to model normal traffic patterns, enabling the detection of anomalies that may indicate cyber-attacks, including unknown and zero-day threats. Real-time alerts are generated when anomalies are identified, triggering immediate responses to neutralize potential threats, such as isolating malicious traffic or blocking suspicious activity. Deep Q-Networks (DQN) are employed to enhance the system's adaptability, allowing it to learn from new attack patterns and continuously improve detection accuracy over time. Proximal Policy Optimization (PPO) is integrated to manage network traffic during threat mitigation, ensuring smooth traffic flow and preventing congestion or downtime. Additionally, Genetic Algorithms (GA) are used to fine-tune the parameters of the machine learning models, optimizing both detection performance and network efficiency. To address the common issue of class imbalance in cybersecurity datasets, particularly where benign traffic vastly outnumbers malicious instances, resampling techniques and class weight adjustments are applied. These methods ensure that the system effectively detects minority attack classes, preventing them from being overlooked. The performance of the system is evaluated using a range of metrics, including precision, recall, F1-score, and confusion matrices, with the goal of achieving high detection rates and minimizing false positives. Scalability and adaptability are core features of the system. It is designed to function across a wide range of network topologies and scales, making it applicable to both small and large enterprise environments. Extensive testing is conducted to ensure reliable performance under varying network conditions. A user-friendly interface is developed, allowing network administrators to monitor traffic, receive threat alerts, and track system performance, making it accessible even to users with limited technical expertise. In conclusion, this project provides an advanced, AI-powered cybersecurity solution that enhances real-time threat detection, automates defensive actions, and optimizes network performance. By integrating cutting-edge machine learning techniques, this system strengthens an organizations ability to defend against the evolving landscape of cyber threats, ensuring both network security and operational efficiency.
