Abstract

Brain tumors are one of the most critical medical conditions requiring accurate and timely diag- nosis for effective treatment. The complexity of brain tumor detection and analysis presents a challenge due to the intricate structures within the brain and the variability in tumor shapes, sizes, and locations. This project focuses on building a comprehensive pipeline for brain tumor detec- tion and analysis, leveraging deep learning techniques, specifically convolutional neural networks (CNNs) and U-Net architectures. The ultimate goal is to detect brain tumors from MRI scans, seg- ment the region of interest, and analyze the tumors characteristics and patterns, with the possibility of providing a 3D visualization of the tumor. In the preliminary phase of this project, Convolutional Neural Networks (CNNs) are utilized for brain tumor detection in MRI images. CNNs are particularly effective in image classification, enabling the differentiation between images with tumors and those without. This approach fa- cilitates automatic feature extraction, capturing textures, edges, and patterns from the MRI data, thereby reducing human error and enhancing detection accuracy. Following tumor detection, region-specific analysis is conducted using the U-Net model, which is renowned for its application in medical image segmentation. U-Nets architecture, comprising a contracting path for context capture and a symmetric expanding path for precise localization, allows for accurate segmentation of the tumor. This enables the isolation of the tumors location and shape, providing detailed insights into its extent and characteristics. Subsequent to segmentation, various tumor attributes, including size, shape, texture, and growth over time, are analyzed. This analysis aims to uncover insights into the tumors behavior and pro- gression, which are critical for treatment planning and prognosis. In particular, tracking changes in tumor size and structure across multiple MRI scans is essential for determining whether the tumor is expanding or shrinking. This ongoing assessment is vital for evaluating the effectiveness of current treatment strategies, ultimately enhancing patient care and outcomes. This project explores the generation of 3D visualizations of brain tumors using segmented regions from the U-Net model. These 3D representations offer a comprehensive view of the tu- mors spatial structure, aiding both medical professionals and patients in understanding the tumors effects on surrounding tissues. This enhanced visualization facilitates more informed decision- making in clinical settings. The overarching goal of this project is to develop an integrated approach to brain tumor detec- tion and analysis. The project begins with basic detection through Convolutional Neural Networks (CNNs), progressing to region-specific analysis with U-Net and advanced tumor characterization. The incorporation of 3D visualizations adds significant depth to the analysis, improving the clinical utility of the system. By employing state-of-the-art deep learning techniques, this project aims to advance medical imaging technologies, enhancing patient outcomes in brain tumor management.
